Individual Fairness in Machine Learning

In today’s rapidly evolving tech-driven world, fairness is a cornerstone of building trust and integrity within organizational decision-making systems. Artificial intelligence (AI) and machine learning (ML) algorithms are increasingly being used to make key decisions in areas such as hiring, lending, and college admissions. However, a critical concept that has emerged in this domain is individual fairness. Despite its importance, achieving individual fairness in machine learning models is complicated and often misunderstood. In this blog post, I’ll explore the concept of individual fairness, its implications for organizations, and share personal insights and practical advice on how to address its challenges effectively.

What is Individual Fairness?

At its core, individual fairness is the idea that similar individuals should be treated similarly by a decision-making system. This principle is essential when designing AI models that impact people’s lives, such as in hiring, lending, or healthcare. The concept was introduced to address concerns about the limitations of traditional fairness metrics, such as statistical parity, which can sometimes overlook individual nuances in decision-making.

For instance, when using a model for job applicant screening, individual fairness would ensure that two candidates with similar qualifications and experience receive similar predictions and treatment. This avoids situations where a more qualified candidate is passed over in favour of someone with less experience simply because they belong to a protected group.

The Need for Individual Fairness

Why does individual fairness matter? The answer lies in the growing awareness of how biased systems and unfair treatment can perpetuate inequality. One of the most compelling reasons to embrace individual fairness is its ability to promote justice on a granular level. When fairness is defined in terms of individual merit, there is a greater emphasis on ensuring that no one is unfairly disadvantaged or advantaged based on irrelevant attributes such as race, gender, or age.

For example, in a hiring process, if two candidates are equally qualified and experienced, but one is rejected because their name appears to be of a certain ethnicity while the other is accepted, this raises serious ethical concerns. Individual fairness seeks to prevent such biases by focusing on individual attributes that are truly relevant to the task at hand.

The Complications of Individual Fairness

While the concept of individual fairness seems straightforward in theory, its implementation is anything but simple. The challenges largely stem from two key areas: defining “similarity” and applying fairness consistently across diverse datasets.

1. Defining Similarity

The first challenge is how to define “similarity” between individuals. To ensure that similar individuals are treated similarly, we need to establish a way to measure what makes individuals “similar” in the context of the specific decision-making process. For example, in a college admissions scenario, similarity might be defined based on academic performance, extracurricular activities, and personal experiences. But what if some attributes are subjective or difficult to quantify?

This is where I’ve encountered challenges in my own work with AI systems. For instance, when working on AI-driven recruitment tools, defining what constitutes “similarity” between candidates can be tricky. In some cases, features such as personality traits or cultural fit, which may not be easily quantified, play an important role in hiring decisions. Balancing these subjective factors while still maintaining fairness has been a key challenge.

Defining similarity can be context-dependent and varies based on the task at hand. Fair-ML on individual fairness measure focus is on similarity. This can be challenging because the “distance metric” used to quantify similarity must be carefully defined. This metric, often based on task-relevant attributes, can sometimes be difficult to agree upon and implement consistently.

2. The Group vs. Individual Fairness Debate

Another significant complication is the perceived conflict between group fairness and individual fairness. Group fairness metrics, such as statistical parity, aim to ensure equal treatment across different demographic groups. However, these measures can sometimes overlook disparities within subgroups, leading to issues like fairness gerrymandering. For instance, if a decision-making model is designed to ensure equal representation of different demographic groups, it might unfairly prioritize group-level fairness at the expense of individual fairness.

Binns (2020) has explored this issue in depth, noting that the apparent conflict between group and individual fairness often arises from the uncritical application of fairness metrics without considering their specific deployment context. He argues that group fairness measures, while important, can sometimes lead to outcomes that are intuitively unfair at the individual level, such as choosing candidates based on group membership rather than individual qualifications.

This issue is exemplified in Fair-ML, where the challenge lies in balancing the need to address systemic inequalities with ensuring that similar individuals are treated similarly. This is where individual fairness measures, which are rooted in treating similar individuals similarly based on task-relevant attributes, come into play. However, Binns (2020) contends that individual fairness can often be seen as a subset of group fairness, as it groups individuals based on feature similarity. This perspective challenges the notion that individual and group fairness are fundamentally distinct or conflicting principles.

Egalitarian Fairness and the Unity of Principles

Binns (2020) further explores egalitarian fairness theories, which seek to reconcile individual and group fairness within a unified framework. These theories do not inherently place individual and group fairness in opposition but rather suggest that both concepts can coexist without conflict. By aligning fairness metrics with broader egalitarian principles, the tension between individual and group fairness can be resolved.

This approach is essential for organizations as they seek to implement fairness in real-world contexts. Rather than choosing between individual or group fairness, the focus should be on understanding how both principles can complement each other to achieve a more comprehensive notion of fairness. For instance, while ensuring that individuals within groups are treated equitably, organizations must also address broader structural disparities that affect individuals’ opportunities and outcomes.

Summary

As organizations continue to integrate AI into their decision-making processes, individual fairness must remain a priority. By focusing on defining similarity, conducting regular audits, and leveraging ethical expertise, leaders can ensure that their systems operate fairly and with integrity. The journey toward achieving individual fairness in AI is complex, but with the right strategies in place, it is entirely achievable.

The real takeaway from my work on individual fairness is that it’s not just about implementing fairness metrics—it’s about adopting a mindset of fairness at every stage of the decision-making process. While fairness metrics, such as those outlined by John, Sharifi, and Li in their research papers, can guide us, the true challenge lies in recognizing the nuances of fairness in context.

In my experience, a holistic approach to fairness is the most effective. This involves recognizing both individual attributes and broader systemic factors. By balancing these two perspectives, organizations can foster a culture of fairness that benefits both individuals and the greater community.
