Understanding Feedback Bias

Feedback bias in AI model tuning occurs when participants providing input are overrepresented in specific communities or share similar feature sets. This overrepresentation can skew the model’s adjustments, causing it to align more closely with the preferences of that particular group, rather than reflecting a broader or more balanced perspective.

Feedback bias can occur after the design and development (DE) phase and even after a project has been deployed. This type of bias arises when the outputs of a machine learning (ML) application influence the features that are later used as new inputs for the system. As algorithms are refined over time—such as through re-training with updated data—this process can create a feedback loop.

If the outcomes of the ML application affect the training data, even a small initial bias can be amplified over time. This self-reinforcing cycle makes it critical to monitor and manage how the outputs of ML systems are integrated back into their training pipelines to prevent the unintended escalation of bias.

Example of Feedback Bias in Machine Learning

“Illustration: Once a certain content got a good ranking by a rating algorithm based on the number of times it has been clicked, it will affect the position and the promotion of this content, thus leading to even more clicks. A reinforcing feedback loop is created and can lead to decreased user satisfaction as not the best content is promoted to the web user” Fahse et al.,(2021).

Causes of Feedback Bias in Machine Learning

Feedback loops are a common challenge in multi-step recommender systems. When recommendations are made, they can influence user behavior, such as the choices users make or the actions they take. This user behavior, in turn, affects the data used to retrain the recommendation system, creating a cycle where recommendations shape future recommendations.

These feedback loops can lead to several issues:

  1. Bias in Understanding User Preferences: The system may overemphasize certain preferences based on past recommendations, distorting its understanding of what users genuinely want.
  2. Compromised Recommendation Quality: Over time, the quality of recommendations may decline as the system becomes less responsive to true user needs and more aligned with its own biased patterns.
  3. Homogenization of Recommendations: The system may start offering overly similar recommendations to users, reducing diversity and limiting exposure to a broader range of options.
